From Data to Decisions: Building Products That Actually Get Used
Most data science work never reaches production. Models get built, dashboards get launched, reports get circulated, and then nothing changes. The analysis sits in a shared folder, admired in a meeting, and quietly forgotten.
The gap between insight and action is a design problem, a communication problem, and sometimes a courage problem. Understanding why this happens requires looking at two things together: what data products actually are, and how the people who need them learn to trust what they say.
What a Data Product Actually Does
A data product is any application that transforms raw data into something of value: a prediction, a recommendation, a ranking, a detection, an optimization. The category is wide. A fraud detection system is a data product. So is a customer churn model, a search ranking algorithm, a demand forecast, and a personalized content feed.
What unites them is purpose. Each one amplifies or extends a human capability at a scale no individual could achieve alone. A recommender system replicates the judgment of a knowledgeable salesperson across millions of simultaneous decisions. A demand forecasting model extends a supply chain planner’s reasoning across thousands of product-location combinations updated daily.
This framing matters because it reorients the design question. Instead of asking “what can we build with this data?” the better question is “which human capability, if scaled or sharpened, would create the most value here?” Start from the capability gap, not the data asset.
There is a counterintuitive implication here. The organizations with the most data are often the worst at building data products, precisely because the abundance of data makes the starting-with-data approach feel natural. The constraint that forces good product thinking is scarcity: when data is limited, you have to be precise about which decision you’re serving. Abundance lets you skip that discipline, and the products that result tend to be impressive and unused.
Teams that skip this step build impressive demonstrations. Teams that start here build things that get used.
The Experiments That Never Ship
There is a pattern in data science organizations that surfaces often enough to warrant naming. A team identifies a promising use case, builds a model that performs well in evaluation, presents results to stakeholders, and then silence. The project enters a holding pattern. Requirements drift. Priorities shift. The model ages. Eventually someone builds a slightly different version of the same thing and the cycle repeats.
This pattern reflects a failure of product thinking, not technical execution.
Production-bound data products share a few characteristics that experimental work often lacks. They have a defined owner, someone accountable for the output who will feel the consequence of a wrong prediction. They have a clear integration point, a specific decision or workflow that the product plugs into. And they have an agreed-upon definition of good enough, established before the model is built.
That last point is the most commonly skipped. “Good enough” requires a negotiation between the data scientist who understands the model’s limitations and the business stakeholder who understands the cost of being wrong. A fraud model that catches 80% of fraud while blocking 2% of legitimate transactions might be excellent for one business and catastrophic for another. Without that conversation happening early, teams optimize for metrics that nobody actually cares about.
The technical work of building a model is rarely what keeps data products from shipping. What keeps them from shipping is the absence of a shared definition of value, one concrete enough to guide tradeoffs and specific enough to evaluate when you are done.
Analysis Answers a Question. A Product Changes Behavior.
There is an intermediate category worth distinguishing: analysis. The confusion between analysis and product is responsible for enormous amounts of wasted work.
Analysis has its place. It generates hypotheses. It surfaces patterns. It makes an argument. But analysis places the entire burden of action on the reader. The reader must understand the finding, translate it into a decision, and then motivate themselves to act on it. That is three cognitive steps, each of which represents a place where momentum dies.
A well-designed data product collapses those steps. The fraud score blocks or flags the transaction directly. The recommendation engine presents options ordered by predicted relevance. The insight and the action become the same thing.
The design question that follows is worth getting right: what is the minimum human intervention required to act on this insight? Reserve human attention for the decisions that genuinely need it. Automate the rest. The organizations that struggle here tend to automate the easy decisions and leave humans to wrestle with the hard ones without adequate support. The better design gives the human both the recommendation and the context to override it when their judgment says the model is wrong.
The Craft of Data Storytelling
Even when a data product does not fully automate a decision, a communication layer determines whether the insight reaches its intended audience intact. This is data storytelling, and it is underestimated in proportion to how much it matters.
Consider a merchandising team at a mid-sized retailer. They had a well-validated model predicting which products to promote in each regional market. The data science team presented results in a twelve-slide deck: feature importances, confidence intervals, lift curves, a methodology appendix. The merchandising managers sat through the presentation, asked polite questions about sample size, and went back to the spreadsheet they’d been using for three years. Six months later, the model sat unused.
The analysts rebuilt the output as a one-page brief: here’s what we found, here’s the business implication, here’s which products to move and in which markets. The recommendation was the same. The framing was completely different. Adoption followed within weeks.
This is what storytelling in analytics actually means. The structure follows a recognizable logic: establish context, deliver findings organized by theme rather than chronology, draw conclusions, and name the questions that remain open. When that structure is absent, even accurate analysis gets ignored. Decision-makers are busy. If they have to do the translation work themselves, most won’t.
The harder challenge is audience calibration. A CFO needs revenue impact and confidence level. A product manager needs user behavior and actionable levers. An operator needs to know what to do differently tomorrow morning. Each is a real question deserving a real answer. Presenting the same slide deck to all three and expecting the insight to land is a design failure.
Closing the Loop
The most durable data products fit cleanly into an existing decision. The model output shows up in the right place, in the right form, at the right moment. The person using the output understands what it means and trusts it enough to act. And there is feedback, some mechanism by which the product learns whether its outputs led to good outcomes, and improves.
That feedback element is what separates a data product from a report. Reports do not learn. Products can.
Building that feedback loop requires humility about what the first version will get wrong. It requires stakeholders willing to share outcome data. And it requires data scientists willing to treat model performance in the wild as more informative than model performance in evaluation. Held-out test sets are clean. Reality is not.
There is something worth pausing on here. Every data product that goes unused represents a decision made without the best available information. The cost accumulates quietly, in missed interventions, resources deployed to the wrong priorities, opportunities that look obvious only in hindsight. Organizations often develop analytical capacity well before they develop the organizational habits to absorb it. The product can be right and still arrive too early, framed wrong, or aimed at a decision that was already made informally by the time the analysis surfaced.
The organizations that build data products well have learned to treat the gap between model and production as design space rather than deployment risk. They invest in the storytelling that builds stakeholder trust. They define value before they measure performance. They design for the decision, not the demonstration.
Every data product begins as a question: which human capability, if extended, would matter most? The work is translating that question into something that runs in production, earns the trust of the people who use it, and gets better over time. That is the whole job. Most of the difficulty lives outside the model.
